This document proposes a forecasting model for retailers based on customer segmentation using data mining techniques. The key steps are:
1. Customers are segmented into clusters using a data mining technique like k-means clustering based on their demographic and purchase behavior attributes.
2. For each customer segment, a seasonal ARIMA model with predictors is used to forecast demand.
3. The forecasts for each segment are summed to obtain an overall demand forecast.
4. The forecasting model is used to determine inventory levels and order quantities for a periodic review inventory replenishment policy.

This research was conducted among consumers of famous retail stores (e.g. Carrefour, Giant,
Hypermart, Lotte, etc.) which offering private label brands in Jakarta. This study aimed to analyze the influence of
attitude and brand awareness toward private label brands purchase intention. The assumed sample size was 150
respondents by using convenience sampling technique. The multiple regression model was used in this research
data. The result shows there was relationship found among all the given variables, which means that all research
hypotheses were found to be supported. These findings are expected to provide useful managerial implications for
retailers in terms of effective solutions marketing for private label brands.

A potential objective of every financial organization is to retain existing customers and attain new
prospective customers for long-term. The economic behaviour of customer and the nature of the
organization are controlled by a prescribed form called Know Your Customer (KYC) in manual banking.
Depositor customers in some sectors (business of Jewellery/Gold, Arms, Money exchanger etc) are with
high risk; whereas in some sectors (Transport Operators, Auto-delear, religious) are with medium risk;
and in remaining sectors (Retail, Corporate, Service, Farmer etc) belongs to low risk. Presently, credit risk
for counterparty can be broadly categorized under quantitative and qualitative factors. Although there are
many existing systems on customer retention as well as customer attrition systems in bank, these rigorous
methods suffers clear and defined approach to disburse loan in business sector. In the paper, we have used
records of business customers of a retail commercial bank in the city including rural and urban area of
(Tangail city) Bangladesh to analyse the major transactional determinants of customers and predicting of a
model for prospective sectors in retail bank. To achieve this, data mining approach is adopted for
analysing the challenging issues, where pruned decision tree classification technique has been used to
develop the model and finally tested its performance with Weka result. Moreover, this paper attempts to
build up a model to predict prospective business sectors in retail banking.

By applying RapidMiner workflows has been processed a dataset originated from different data files, and containing information about the sales over three years of a large chain of retail stores. Subsequently, has been constructed a Deep Learning model performing a predictive algorithm suitable for sales forecasting. This model is based on artificial neural network –ANN- algorithm able to learn the model starting from
sales historical data and by pre-processing the data. The best built model uses a multilayer neural network together with an “optimized operator” able to find automatically the best parameter setting of the implemented algorithm. In order to prove the best performing predictive model, other machine learning algorithms have been tested. The performance comparison has been performed between Support Vector
Machine –SVM-, k-Nearest Neighbor k-NN-,Gradient Boosted Trees, Decision Trees, and Deep Learning algorithms. The comparison of the degree of correlation between real and predicted values, the average
absolute error and the relative average error proved that ANN exhibited the best performance. The Gradient Boosted Trees approach represents an alternative approach having the second best performance. The case of study has been developed within the framework of an industry project oriented on the
integration of high performance data mining models able to predict sales using–ERP- and customer relationship management –CRM- tools.

Customer churn is one of the most important metrics for a growing business to evaluate. It is a business term used to describe the loss of clients or customers. In the retail sales and marketing company, customers have multiple choices of services and they frequently switch from one service to another. In these competitive markets, customers demand best products and services at low prices, while service providers constantly focus on getting hold of as their business goals. An increase in customer retention of just 5 can create at least a 25 increase in profit. Therefore, customer churn rate is important because it costs more to acquire new customers than it does to retain existing customers. In this paper, we apply the method to the retail sales and marketing company customer churn data set. This paper provides an extended overview of the literature on the use of data mining in customer churn prediction modeling. AHP Based Data Mining for Customer Segmentation Based on Customer Lifetime ValueIIRindia
Data mining techniques are widely used in various areas of marketing management for extracting useful information.Particularly in a business-to-customer (B2C) setting, it plays an important role in customer segmentation. A retailernot only tries to improve its relationship with its customers,but also enhances its business in a manufacturer-retailer-consumer chainwith respect to this information.Although there are various approaches for customer segmentation, we have used an analytic hierarchical process based data mining technique in this regard. Customers are segmented into six clusters based on Davis-Bouldin (DB) index and K-Means algorithm.Customer lifetime value (CLV)along four dimensions, viz., Length (L), Recency(R), Frequency (F) and Monetary value (M) are considered for these clusters. Then, we apply Saaty’s analytical hierarchical process (AHP) to determine the weights of these criteria, which in turn, helps in computing the CLV value for each of the clusters and their individual rankings. This information is quite important for a retailer to design promotional strategies for improving relationship between the retailer and its customers. To demonstrate the effectiveness of this methodology, we have implemented the model, taking a real life data-base of customers of an organization in the context of an Indian retail industry.

Association rule mining (ARM) is the process of generating rules based on the correlation between the set
of items that the customers purchase.Of late, data mining researchers have improved upon the quality of
association rule mining for business development by incorporating factors like value (utility), quantity of
items sold (weight) and profit. The rules mined without considering utility values (profit margin) will lead
to a probable loss of profitable rules.
The advantage of wealth of the customers’ needs information and rules aids the retailer in designing his
store layout[9]. An algorithm CSHURI, Customer Segmentation using HURI, is proposed, a modified
version of HURI [6], finds customers who purchase high profitable rare items and accordingly classify the
customers based on some criteria; for example, a retail business may need to identify valuable customers
who are major contributors to a company’s overall profit. For a potential customer arriving in the store,
which customer group one should belong to according to customer needs, what are the preferred functional
features or products that the customer focuses on and what kind of offers will satisfy the customer, etc.,
finds the key in targeting customers to improve sales [9], which forms the base for customer utility mining.
Consumer analytics is the process businesses adopt to capture and analyze customer data to make better business decisions via predictive analytics. It is a method of turning data into deep insights to predict customer behavior. It may also be regarded as the process by which data can be turned into predictive insights to develop new products, new ways to package existing products, acquire new customers, retain old customers, and enhance customer loyalty. Two research questions guided the study and two null hypotheses was tested at 0.05 level of significance. The study used Resource Based Theory view to provide understanding on the variables. A descriptive survey research design was adopted for the study. The population of the study consisted of 483 Managers of Small and Medium Scale Enterprise registered with Anambra States Ministry of Commerce and Trade as at December 2021. A structured questionnaire was used for data collection. The questionnaire was validated by experts. From the correlation, a relationship R value of 0.963 with a coefficient of determination was obtained, showing a positive relationship. The regression analysis equally indicated that a unit increase in the application of the inventory management enhanced operational performance of SMSEs in Anambra State. Background and Objective Telehealth has become a well known tool for the delivery of health care in Saudi Arabia, and the perspective and knowledge of healthcare providers are influential in the implementation, adoption and advancement of the method. This systematic review was conducted to examine the current literature base regarding telehealth and the related healthcare professional perspective and knowledge in the Kingdom of Saudi Arabia. Materials and Methods This systematic review was conducted by searching 7 databases including, MEDLINE, CINHAL, Web of Science, Scopus, PubMed, PsycINFO, and ProQuest Central. Studies on healthcare practitioners telehealth knowledge and perspectives published in English in Saudi Arabia from 2000 to 2023 were included. Boland directed this comprehensive review. The researchers examined each connected study using the AXIS tool, which evaluates cross sectional systematic reviews. Narrative synthesis was used to summarise and convey the data. Results Out of 1840 search results, 10 studies were included. Positive outlook and limited knowledge among providers were seen across trials. Healthcare professionals like telehealth for its ability to improve quality, access, and delivery, save time and money, and be successful. Age, gender, occupation, and work experience also affect health workers knowledge. In Saudi Arabia, healthcare professionals face inadequate expert assistance, patient privacy, internet connection concerns, lack of training courses, lack of telehealth understanding, and high costs while performing telemedicine. Conclusions Healthcare practitioners telehealth perceptions and knowledge were examined in this systematic study. This research investigates the nexus between online discussions on Dr. B.R. Ambedkars ideals and their impact on social inclusion among college students in Gurugram, Haryana. Surveying 240 students from 12 government colleges, findings indicate that 65 actively engage in online discussions, with 80 demonstrating moderate to high awareness of Ambedkars ideals. Statistically significant correlations reveal that higher online engagement correlates with increased awareness p 0.05 and perceived social inclusion. Variations across colleges and a notable effect of college type on perceived social inclusion highlight the influence of contextual factors. Furthermore, the intersectional analysis underscores nuanced differences based on gender, caste, and socio economic status. This paper reports on a study which was conducted to investigate the role of mentoring and its influence on the effectiveness of the teaching of Physics in secondary schools in the South West Region of Cameroon. The study adopted the convergent parallel mixed methods design, focusing on respondents in secondary schools in the South West Region of Cameroon. Both quantitative and qualitative data were collected, analysed separately, and the results were compared to see if the findings confirm or disconfirm each other. The quantitative analysis found that majority of the respondents 72 of Physics teachers affirmed that they had more experienced colleagues as mentors to help build their confidence, improve their teaching, and help them improve their effectiveness and efficiency in guiding learners’ achievements. Only 28 of the respondents disagreed with these statements. With majority respondents 72 agreeing with the statements, it implies that in most secondary schools, experienced Physics teachers act as mentors to build teachers’ confidence in teaching and improving students’ learning. The interview qualitative data analysis summarized how secondary school Principals use meetings with mentors and mentees to promote mentorship in the school milieu. This has helped strengthen teachers’ classroom practices in secondary schools in the South West Region of Cameroon. With the results confirming each other, the study recommends that mentoring should focus on helping teachers employ social interactions and instructional practices feedback and clarity in teaching that have direct measurable impact on students’ learning achievements. This study primarily focuses on the design of a high side buck converter using an Arduino microcontroller. The converter is specifically intended for use in DC DC applications, particularly in standalone solar PV systems where the PV output voltage exceeds the load or battery voltage. To evaluate the performance of the converter, simulation experiments are conducted using Proteus Software. These simulations provide insights into the input and output voltages, currents, powers, and efficiency under different state of charge SoC conditions of a 12V,70Ah rechargeable lead acid battery. Additionally, the hardware design of the converter is implemented, and practical data is collected through operation, monitoring, and recording. By comparing the simulation results with the practical results, the efficiency and performance of the designed converter are assessed. The findings indicate that while the buck converter is suitable for practical use in standalone PV systems, its efficiency is compromised due to a lower output current. Generally far more sustainable than fossil fuel are renewable energy sources such as wind, hydroelectric power, solar, and geothermal energy sources. Worthy of note is that some renewable energy projects, like the clearing of forests to produce biofuels, can cause severe environmental damage. The sustainability of nuclear power which is a low carbon source is highly debated because of concerns about radioactive waste, nuclear proliferation, and accidents. The switching from coal to natural gas has environmental benefits, including a lower climate impact, but could lead to delay in switching to more sustainable options. “Carbon capture and storage” can be built into power plants to remove the carbon dioxide CO2 emissions, but this technology is expensive and has rarely been implemented. This paper aims to outline the executive regulations, survey standards, and specifications required for the implementation of the Sudan Survey Act, and for regulating and organizing all surveying work activities in Sudan. The act has been discussed for more than 5 years. The Land Survey Act was initiated by the Sudan Survey Authority and all official legislations were headed by the Sudan Ministry of Justice till it was issued in 2022. The paper presents conceptual guidelines to be used for the Survey Act implementation and to regulate the survey work practice, standardizing the field surveys, processing, quality control, procedures, and the processes related to survey work carried out by the stakeholders and relevant authorities in Sudan. The conceptual guidelines are meant to improve the quality and harmonization of geospatial data and to aid decision making processes as well as geospatial information systems. The established comprehensive executive regulations will govern and regulate the implementation of the Sudan Survey Geomatics Act in all surveying and mapping practices undertaken by the Sudan Survey Authority SSA and state local survey departments for public or private sector organizations. To figure out a solution for Sudans local geoid, this research has tried to intake the possibility of determining the geoid model by following two approaches, gravimetric and geometrical geoid model determination, by making use of GNSS leveling benchmarks at Khartoum state. The Benchmarks are well distributed in the study area, in which, the horizontal coordinates and the height above the ellipsoid have been observed by GNSS while orthometric heights were carried out using precise leveling. The Global Geopotential Model GGM represented in EGM2008 has been exploited to figure out the geoid undulation at the benchmarks in the study area. This is followed by a fitting process, that has been done to suit the geoid undulation data which has been computed using GNSS leveling data and geoid undulation inspired by the EGM2008. Two geoid surfaces were created after the fitting process to ensure that they are identical and both of them could be counted for getting the same geoid undulation with an acceptable accuracy. In this respect, statistical operation played an important role in ensuring the consistency and integrity of the model by applying cross validation techniques splitting the data into training and testing datasets for building the geoid model and testing its eligibility. The geometrical solution for geoid undulation computation has been utilized by applying straightforward equations that facilitate the calculation of the geoid undulation directly through applying statistical techniques for the GNSS leveling data of the study area to get the common equation parameters values that could be utilized to calculate geoid undulation of any position in the study area within the claimed accuracy. Both systems were checked and proved eligible to be used within the study area with acceptable accuracy which may contribute to solving the geoid undulation problem in the Khartoum area, and be further generalized to determine the geoid model over the entire country, and this could be considered in the future, for regional and continental geoid model. ABSTRACT
The purpose of this paper is to develop a forecasting
model for retailers based on customer segmentation,
to improve the performance of inventory. The
research makes an attempt to capture the knowledge
of segmenting the customers based on various
attributes as an input to the demand forecasting in a
retail store. The paper suggests a data mining model
which has been used for forecasting demand. The
proposed model has been applied for forecasting
grocery items in a supermarket. Based
proposed forecasting model, the
performance has been studied by simulation. Hence,
the proposed model in the paper results in improved
performance of inventory. Retailers can make use of
the proposed model for demand forecasting of various
items to improve the inventory performance and
profitability of operations. With the advent of data

2. Literature Review
Improved demand forecasting accuracy can result in
monetary savings, greater competitiveness, enhanced
channel relationships, and customer satisfaction [1].
The importance of accurate sales forecasts to efficient
inventory management has long been recognized.
Barksdale and Hilliard [2] found that successful
inventory management depends to a large extent on
the accurate forecasting of retail sales. Thall [3] and
Agrawal and Schorling [4] also pointed out that
Accurate demand forecasting plays a critical role in
profitable retail operations and poor forecasting
results in under stock or overstock that directly affects
profitability and competitive position of the retailer.
The most common practice of forecasting demand in
supply chain planning involves the use of a statistical
software system which incorporates a simple
univariate forecasting method, such as exponential
smoothing, to produce an initial forecast [5]. The
common practices and various literatures include time
series decomposition, exponential smoothing, time
series regression and autoregressive and integrated
moving average (ARIMA) models. Out of these
models, seasonal ARIMA model has been the most
frequently employed forecasting model that results in
a reasonably acceptable accuracy and it has been
successfully tested in many practical applications [6
and 7].
The traditional methods which include ARIMA also
are linear methods as they assume a linear relationship
between independent and dependent variables. This
problem is overcome by nonlinear methods. Artificial
neural network (ANN) model is one popular nonlinear
model which is extensively used for forecasting
demand. ANN models use multi-layer perceptron
(MLP) which does not need to assume stationary data
in time series. Neural network-based fuzzy time series
models have been used to improve forecasting for the
stock index in Taiwan [8, 9 and 10].
Various data mining applications for inventory
management have been suggested in various works. A
method to select inventory items from the association
rules has been proposed for cross-selling
consideration [11]. This gives methodology to choose
a subset of items which can give the maximal profit
with the consideration of cross- selling effect.
Relevance of association rule mining in the context of
multi-item inventory replenishment has been
discussed [12]. The paper shows with a case that
inventory costs can be reduced with the
implementation of data mining-based replenishment
policy. A decision tree-based model for inventory
replenishment in retail stores has been proposed. The
decision tree is inducted using data mining on sale
transaction data of purchase items with the
demographic profile and other details of the
customers. However, these models do not talk about
forecasting and relevance of accuracy in forecasting
in the performance of inventory in supply chain
management. A decision tree-based application in
retail sales for investigating the impact of promotion
has been used in retail sales. Chang [13] suggest
decision tree-based classification to analyze the
customers’ behavior in order to form the right
customers’ profile and business growth model under
internet and e-commerce environment. In retail sales,
the decision tree is induced for various uses in
customer relationship management.
Feature selection is another data mining technique
which has been widely used for learning customers’
purchase behavior. Feature selection is the technique
used in data mining for identification of the fields
which are the best for prediction [14] as a critical
process. This step helps with both data cleansing and
data reduction, by including the important features
and excluding the redundant, noisy and less
informative ones [15]. There are two main stages to
feature selection. The first is a search strategy for the
identification of the feature subsets and the second is
an evaluation method for testing their integrity, based
on some criteria. Classification of customers with
predefined groups or classes is done after finding the
best features (or, attributes) using feature selection.
Classification of customers after performing feature
selection has several advantages. According to John et
al [16] first, there might be a significant improvement
over the performance of a classification by reducing
the number of bands to a smaller set of informative
features. Second, with a smaller number of bands, the
processing time is greatly reduced. Third, in certain
cases lower- dimensional datasets would be more
appropriate, where a limited amount of training data is
available.
In view of the several applications of data mining in
retailing, it motivates towards devising models for
demand forecasting in retail sales with the potential of
data mining demonstrated in other areas.

3. Developing a Forecasting Model
3.1 Segmenting Customers using Clustering
Managing customers as an asset requires measuring
them and treating them according to their true value.
Customer segmentation is generally done by using the
clustering techniques of data mining. Different
customers’ attributes have been used for segmentation
by clustering technique in retailing. These attributes
include customers’ demographic profile and patterns
in shopping behavior, like the frequency of shopping,
the monetary value of purchase, number of items
purchased, etc. In retailing, segmentation of
customers is done usually for customer relationship
management. Many authors demonstrate the
advantages of applying a K-means clustering
technique to analyze a time series for determining
structural changes low to high or, high to low in the

The main trends for developing models to segment
customers include K-means, Kohonen map, two-step
models. K-means clustering technique does the
clustering in K groups where the similarity amongst
the entities within a cluster is very high and a
reasonably high inter-cluster distance is maintained at
the same time. The two-step node uses two steps for
clustering. The first step makes a single pass through
the data to compress the raw input data into a
manageable set of sub-clusters. The second step uses
a hierarchical clustering method to progressively
merge the sub- clusters into larger and larger clusters.
Two-step has the advantage of automatically
estimating the optimal number of clusters for the
training data. It can handle mixed field types and large
data sets efficiently. Kohonen map is a neural
network-based clustering, where the clusters are
represented by the nodes in two- dimensional
coordinate grids. Sometimes three- dimensional and
one-dimensional grids are also used.
3.2 Developing a forecasting model based on
Clustering
Based on the discussion in the above sections, a
forecasting model has been developed for retail
merchandise. As a prerequisite to the segmentation of
customers, the details of the customers are recorded
along with the amount of purchase. The methodology
involved in the proposed forecasting model can be
described in the following steps:
Step 1 : Exhaustive list of demographic details of the
customers and other details depicting the
purchase behavior is prepared. These details
are used as attributes to describe customers. It
is to be noted that all these attributes are not
equally important in describing an intended
behavior of customers.
Step 2 : Construction of classes of customers is done
for the item/SKU considered for demand
forecasting. For the purpose of demand
forecasting, classes are to be described based
on the units of purchase for the SKU. For
example, two classes of customers may be –
those who purchase one unit and those who
purchase two units or, more.
Step 3 : Based on the target classes, feature selection
is performed on the database to select top few
dominant attributes for the purpose of
classification.
Step 4 : Based on the important attributes obtained
using feature selection, clustering is performed
for the customers.
Step 5 : The original database is segregated based on
the segmentation described by the clusters
obtained. Each cluster is to be treated as a
separate database representing a unique
segment.
Step 6: For each segment of customers, seasonal
ARIMA with predictors are used for
forecasting. Predictors for daily and weekly
forecasting have been identified separately.
Step 7 : To forecast the overall demand of the item,
forecasts for various segments are summed up
3.3 Inventory control with the forecast models
For a periodic review policy of inventory
replenishment, four proposed forecasting models
outperforming other models and the existing
forecasting model have been compared with respect to
two performance indicators:
1. Inventory level given by reaching days of
inventory (measured as inventory/daily sales
average); and
2. Customer service (indicated by percentage of days
with sales failure).
In fact, customer service level is inversely
proportional to “percentage of days with sales
failure”. In periodic review policy using the daily
forecasting, review of the inventory levels is done for
the products every P day and the purchase order has to
be sent at least L days (known as “lead time”) before

the delivery date. The desired inventory level (T) has
to be determined every period by the equation,
T=m0+Zs, where m0 is the average demand during
(P+L) days, Z is obtained from a standard normal
distribution table which depends on the desired
service level and s is standard deviation of the
demand during (P+L) days, (P+L) is known as
protection period and Zs is the safety stock.
In both daily and weekly forecasting, following data
has been used:
P= 7 days
L=3 days
Service level = 90 percent,
The computation for daily forecasting has been shown

remain same given in days, it is required to convert
the weekly figures into daily figures. The computation
for weekly forecasting has been shown below:

4. Conclusion
The proposed business intelligence system for
demand forecasting proves to give more accurate
predictions for future demands compared to the
existing models and practices in the supermarket. This
helps inventory managers to better manage their
supply chain performance by reducing reaching days
and service level simultaneously. Reaching day as a
measure of inventory level is generally reduced
successfully by the retailers at the cost of service level
in most of the places. In the present day order, where,
most of the large supermarkets are taking resort to
data mining for various uses in customer relationship
management, enhancing inventory management with
the use of clustering of records after identifying the
important features will be an additional application
for increasing profitability of operations.
