Spark-Streaming-as-a-Service with Kafka and YARN: Spark Summit East talk by J...
Since April 2016, Spark-as-a-service has been available to researchers in Sweden from the Swedish ICT SICS Data Center at www.hops.site. Researchers work in an entirely UI-driven environment on a platform built with only open-source software.
Spark applications can be either deployed as jobs (batch or streaming) or written and run directly from Apache Zeppelin. Spark applications are run within a project on a YARN cluster with the novel property that Spark applications are metered and charged to projects. Projects are also securely isolated from each other and include support for project-specific Kafka topics. That is, Kafka topics are protected from access by users that are not members of the project. In this talk we will discuss the challenges in building multi-tenant Spark streaming applications on YARN that are metered and easy-to-debug. We show how we use the ELK stack (Elasticsearch, Logstash, and Kibana) for logging and debugging running Spark streaming applications, how we use Graphana and Graphite for monitoring Spark streaming applications, and how users can debug and optimize terminated Spark Streaming jobs using Dr Elephant. We will also discuss the experiences of our users (over 120 users as of Sept 2016): how they manage their Kafka topics and quotas, patterns for how users share topics between projects, and our novel solutions for helping researchers debug and optimize Spark applications.
To conclude, we will also give an overview on our course ID2223 on Large Scale Learning and Deep Learning, in which 60 students designed and ran SparkML applications on the platform.
Running Spark Inside Containers with Haohai Ma and Khalid Ahmed
This presentation describes the journey we went through in containerizing Spark workload into multiple elastic Spark clusters in a multi-tenant kubernetes environment. Initially we deployed Spark binaries onto a host-level filesystem, and then the Spark drivers, executors and master can transparently migrate to run inside a Docker container by automatically mounting host-level volumes. In this environment, we do not need to prepare a specific Spark image in order to run Spark workload in containers. We then utilized Kubernetes helm charts to deploy a Spark cluster. The administrator could further create a Spark instance group for each tenant. A Spark instance group, which is akin to the Spark notion of a tenant, is logically an independent kingdom for a tenant’s Spark applications in which they own dedicated Spark masters, history server, shuffle service and notebooks. Once a Spark instance group is created, it automatically generates its image and commits to a specified repository. Meanwhile, from Kubernetes’ perspective, each Spark instance group is a first-class deployment and thus the administrator can scale up/down its size according to the tenant’s SLA and demand. In a cloud-based data center, each Spark cluster can provide a Spark as a service while sharing the Kubernetes cluster. Each tenant that is registered into the service gets a fully isolated Spark instance group. In an on-prem Kubernetes cluster, each Spark cluster can map to a Business Unit, and thus each user in the BU can get a dedicated Spark instance group. The next step on this journey will address the resource sharing across Spark instance groups by leveraging new Kubernetes’ features (Kubernetes31068/9), as well as the Elastic workload containers depending on job demands (Spark18278). APACHE TOREE: A JUPYTER KERNEL FOR SPARK by Marius van Niekerk
Many data scientists are already making heavy usage of the Jupyter ecosystem for analyzing data using interactive notebooks.
Apache Toree (incubating) is a Jupyter kernel designed to act as a gateway to Spark by enabling users Spark from standard Jupyter notebooks. This allows users to easily integrate Spark into their existing Jupyter deployments, This allows users to easily move between languages and contexts without needing to switch to a different set of tools.
Apache Toree is designed expressly for interactive work. It supports interpreters in Scala, Python, and R.
In this talk, I will cover the design of Toree, how it interacts with the Jupyter ecosystem and various ways in which users can extend the functionality of Apache Toree via a powerful plugin system.
Spark Pipelines in the Cloud with Alluxio with Gene Pang
Organizations commonly use Apache Spark to gain actionable insight from their large amounts of data. Often, these analytics are in the form of data processing pipelines, where there are a series of processing stages, and each stage performs a particular function, and the output of one stage is the input of the next stage. There are several examples of pipelines, such as log processing, IoT pipelines, and machine learning. The common attribute among different pipelines is the sharing of data between stages. It is also common for Spark pipelines to process data stored in the public cloud, such as Amazon S3, Microsoft Azure Blob Storage, or Google Cloud Storage. The global availability and cost effectiveness of these public cloud storage services make them the preferred storage for data. However, running pipeline jobs while sharing data via cloud storage can be expensive in terms of increased network traffic, and slower data sharing and job completion times. Using Alluxio, a memory speed virtual distributed storage system, enables sharing data between different stages or jobs at memory speed. By reading and writing data in Alluxio, the data can stay in memory for the next stage of the pipeline, and this result in great performance gains. In this talk, we discuss how Alluxio can be deployed and used with a Spark data processing pipeline in the cloud. We show how pipeline stages can share data with Alluxio memory for improved performance benefits, and how Alluxio can improves completion times and reduces performance variability for Spark pipelines in the cloud.

HDFS on Kubernetes—Lessons Learned with Kimoon Kim
There is growing interest in running Apache Spark natively on Kubernetes (see https://github.com/apache-spark-on-k8s/spark). Spark applications often access data in HDFS, and Spark supports HDFS locality by scheduling tasks on nodes that have the task input data on their local disks. When running Spark on Kubernetes, if the HDFS daemons run outside Kubernetes, applications will slow down while accessing the data remotely.
This session will demonstrate how to run HDFS inside Kubernetes to speed up Spark. In particular, it will show how Spark scheduler can still provide HDFS data locality on Kubernetes by discovering the mapping of Kubernetes containers to physical nodes to HDFS datanode daemons. You’ll also learn how you can provide Spark with the high availability of the critical HDFS namenode service when running HDFS in Kubernetes.

Teaching Apache Spark Clusters to Manage Their Workers Elastically: Spark Sum...
Devops engineers have applied a great deal of creativity and energy to invent tools that automate infrastructure management, in the service of deploying capable and functional applications. For data-driven applications running on Apache Spark, the details of instantiating and managing the backing Spark cluster can be a distraction from focusing on the application logic. In the spirit of devops, automating Spark cluster management tasks allows engineers to focus their attention on application code that provides value to end-users.
Using Openshift Origin as a laboratory, we implemented a platform where Apache Spark applications create their own clusters and then dynamically manage their own scale via host-platform APIs. This makes it possible to launch a fully elastic Spark application with little more than the click of a button.
We will present a live demo of turn-key deployment for elastic Apache Spark applications, and share what we’ve learned about developing Spark applications that manage their own resources dynamically with platform APIs.
The audience for this talk will be anyone looking for ways to streamline their Apache Spark cluster management, reduce the workload for Spark application deployment, or create self-scaling elastic applications. Attendees can expect to learn about leveraging APIs in the Kubernetes ecosystem that enable application deployments to manipulate their own scale elastically.

Kubernetes is a fast growing open-source platform which provides container-centric infrastructure. Conceived by Google in 2014, and leveraging over a decade of experience running containers at scale internally, it is one of the fastest moving projects on GitHub with 1000+ contributors and 40,000+ commits. Kubernetes has first class support on Google Cloud Platform, Amazon Web Services, and Microsoft Azure.
Unlike YARN, Kubernetes started as a general purpose orchestration framework with a focus on serving jobs. Support for long-running, data intensive batch workloads required some careful design decisions. Engineers across several organizations have been working on Kubernetes support as a cluster scheduler backend within Spark. During this process, we encountered several challenges in translating Spark considerations into idiomatic Kubernetes constructs. In this talk, we describe the challenges and the ways in which we solved them. This talk will be technical and is aimed at people who are looking to run Spark effectively on their clusters. The talk assumes basic familiarity with cluster orchestration and containers.

Using Apache Spark in the Cloud—A Devops Perspective with Telmo Oliveira
Toon is a leading brand in the European smart energy market, currently expanding internationally, providing energy usage insights, eco-friendly energy management and smart thermostat use for the connected home. As value added services become ever more relevant in this market, we have the need to ensure that we can easily and safely on-board new tenants into our data platform. In this talk we’re going to guide you across a less discussed side of using Spark in production – devops. We will speak about our journey from an on-premise cluster to a managed solution in the cloud. A lot of moving parts were involved: ETL flows, data sharing with 3rd parties and data migration to the new environment. Add to this the need to have a multi-tenant environment, revamp our toolset and deploy a live public facing service. It’s possible to find a lot of great examples of how Spark is used for data-science purposes. On the data engineering side, we need to deploy production services, ensure data is cleaned, secured and available, and keep the data-science teams happy. There is growing interest in running Apache Spark natively on Kubernetes (see https://github.com/apache-spark-on-k8s/spark). Spark applications often access data in HDFS, and Spark supports HDFS locality by scheduling tasks on nodes that have the task input data on their local disks. When running Spark on Kubernetes, if the HDFS daemons run outside Kubernetes, applications will slow down while accessing the data remotely.
This session will demonstrate how to run HDFS inside Kubernetes to speed up Spark. In particular, it will show how Spark scheduler can still provide HDFS data locality on Kubernetes by discovering the mapping of Kubernetes containers to physical nodes to HDFS datanode daemons. Devops engineers have applied a great deal of creativity and energy to invent tools that automate infrastructure management, in the service of deploying capable and functional applications. For data-driven applications running on Apache Spark, the details of instantiating and managing the backing Spark cluster can be a distraction from focusing on the application logic. In the spirit of devops, automating Spark cluster management tasks allows engineers to focus their attention on application code that provides value to end-users.
Using Openshift Origin as a laboratory, we implemented a platform where Apache Spark applications create their own clusters and then dynamically manage their own scale via host-platform APIs. This makes it possible to launch a fully elastic Spark application with little more than the click of a button.
We will present a live demo of turn-key deployment for elastic Apache Spark applications, and share what we’ve learned about developing Spark applications that manage their own resources dynamically with platform APIs.
The audience for this talk will be anyone looking for ways to streamline their Apache Spark cluster management, reduce the workload for Spark application deployment, or create self-scaling elastic applications. Kubernetes is a fast growing open-source platform which provides container-centric infrastructure. Conceived by Google in 2014, and leveraging over a decade of experience running containers at scale internally, it is one of the fastest moving projects on GitHub with 1000+ contributors and 40,000+ commits. Kubernetes has first class support on Google Cloud Platform, Amazon Web Services, and Microsoft Azure.
Unlike YARN, Kubernetes started as a general purpose orchestration framework with a focus on serving jobs. Support for long-running, data intensive batch workloads required some careful design decisions. Engineers across several organizations have been working on Kubernetes support as a cluster scheduler backend within Spark. During this process, we encountered several challenges in translating Spark considerations into idiomatic Kubernetes constructs. In this talk, we describe the challenges and the ways in which we solved them. This talk will be technical and is aimed at people who are looking to run Spark effectively on their clusters. The talk assumes basic familiarity with cluster orchestration and containers.

Typical solutions rely on periodically retrained batch algorithms, but for massive amounts of data, training a new model could take hours. This is a problem when the model needs to be more up-to-date. For example, when recommending TV programs while they are being transmitted the model should take into consideration users who watch a program at that time.
The promise of online recommendation systems is fast adaptation to changes, but methods of online machine learning from streams is commonly believed to be more restricted and hence less accurate than batch trained models. Combining batch and online learning could lead to a quickly adapting recommendation system with increased accuracy. However, designing a scalable data system for uniting batch and online recommendation algorithms is a challenging task. DeepLearning is not just a hype - it outperforms state-of-the-art ML algorithms. One by one. In this talk we will show how DeepLearning can be used for detecting anomalies on IoT sensor data streams at high speed using DeepLearning4J on top of different BigData engines like ApacheSpark and ApacheFlink. Key in this talk is the absence of any large training corpus since we are using unsupervised machine learning - a domain current DL research threats step-motherly. As we can see in this demo LSTM networks can learn very complex system behavior - in this case data coming from a physical model simulating bearing vibration data. Once draw back of DeepLearning is that normally a very large labaled training data set is required. This is particularly interesting since we can show how unsupervised machine learning can be used in conjunction with DeepLearning - no labeled data set is necessary. We are able to detect anomalies and predict braking bearings with 10 fold confidence. All examples and all code will be made publicly available and open sources. QE automation for large systems is a great step forward in increasing system reliability. In the big-data world, multiple components have to come together to provide end-users with business outcomes. This means, that QE Automations scenarios need to be detailed around actual use cases, cross-cutting components. The system tests potentially generate large amounts of data on a recurring basis, verifying which is a tedious job. Given the multiple levels of indirection, the false positives of actual defects are higher, and are generally wasteful.
At Hortonworks, we’ve designed and implemented Automated Log Analysis System - Mool, using Statistical Data Science and ML. Currently the work in progress has a batch data pipeline with a following ensemble ML pipeline which feeds into the recommendation engine. The system identifies the root cause of test failures, by correlating the failing test cases, with current and historical error records, to identify root cause of errors across multiple components. The system works in unsupervised mode with no perfect model/stable builds/source-code version to refer to. In addition the system provides limited recommendations to file/open past tickets and compares run-profiles with past runs.

In this talk, we will present a new distribution of Hadoop, Hops, that can scale the Hadoop Filesystem (HDFS) by 16X, from 70K ops/s to 1.2 million ops/s on Spotiy's industrial Hadoop workload. Hops is an open-source distribution of Apache Hadoop that supports distributed metadata for HSFS (HopsFS) and the ResourceManager in Apache YARN. HopsFS is the first production-grade distributed hierarchical filesystem to store its metadata normalized in an in-memory, shared nothing database. For YARN, we will discuss optimizations that enable 2X throughput increases for the Capacity scheduler, enabling scalability to clusters with >20K nodes. We will discuss the journey of how we reached this milestone, discussing some of the challenges involved in efficiently and safely mapping hierarchical filesystem metadata state and operations onto a shared-nothing, in-memory database. We will also discuss the key database features needed for extreme scaling, such as multi-partition transactions, partition-pruned index scans, distribution-aware transactions, and the streaming changelog API. Hops (www.hops.io) is Apache-licensed open-source and supports a pluggable database backend for distributed metadata, although it currently only support MySQL Cluster as a backend. Hops opens up the potential for new directions for Hadoop when metadata is available for tinkering in a mature relational database.

While you could be tempted assuming data is already safe in a single Hadoop cluster, in practice you have to plan for more. Questions like: "What happens if the entire datacenter fails?, or "How do I recover into a consistent state of data, so that applications can continue to run?" are not a all trivial to answer for Hadoop. Did you know that HDFS snapshots are handling open files not as immutable? Or that HBase snapshots are executed asynchronously across servers and therefore cannot guarantee atomicity for cross region updates (which includes tables)? There is no unified and coherent data backup strategy, nor is there tooling available for many of the included components to build such a strategy. The Hadoop distributions largely avoid this topic as most customers are still in the "single use-case" or PoC phase, where data governance as far as backup and disaster recovery (BDR) is concerned are not (yet) important. This talk first is introducing you to the overarching issue and difficulties of backup and data safety, looking at each of the many components in Hadoop, including HDFS, HBase, YARN, Oozie, the management components and so on, to finally show you a viable approach using built-in tools. You will also learn not to take this topic lightheartedly and what is needed to implement and guarantee a continuous operation of Hadoop cluster based solutions.
